# 🏗️ How I Built a Production LLMOps Pipeline on AWS AgentCore — End to End
**Author:** Ramandeep Chandna | **Date:** July 2026
**Level:** 400 (Expert) | **Time to Build:** ~8 hours | **Region:** us-east-1
**GitHub:** https://github.com/catchmeraman/LLMOps-Pipeline-AgentCore
## 🎯 What This Blog Covers (And Why It's Different)
This is **not** a tutorial. This is a **production implementation journal** — documenting exactly how I built, deployed, broke, fixed, and shipped a complete LLMOps pipeline on AWS. Every command ran. Every error hit. Every solution found.
**What we build:**
- ✅ A production AI agent with 8 tools (Strands + Claude Sonnet 4)
- ✅ Bedrock Guardrails (content filter + PII redaction + prompt injection defense)
- ✅ AgentCore Gateway with MCP protocol (REST APIs as agent tools)
- ✅ CI/CD pipeline (CodeCommit → CodeBuild ARM64 → ECR → AgentCore auto-deploy)
- ✅ Automated evaluation (LLM-as-Judge + quality gates blocking bad deploys)
- ✅ Model monitoring (latency, tokens, cost, quality drift)
- ✅ Prompt versioning (DynamoDB registry with staging → active → deprecated)
- ✅ Cedar policies (fine-grained tool-level authorization)
- ✅ Cross-session memory (AgentCore Memory)
**Skills demonstrated:**
- Amazon Bedrock AgentCore Runtime (container-based agents)
- Amazon Bedrock Guardrails (safety + prompt injection)
- AgentCore Gateway + MCP Protocol
- AgentCore Memory (cross-session persistence)
- Cedar Policy Language (authorization)
- Strands Agents Framework
- CodePipeline + CodeBuild (ARM64)
- ECR + Docker (multi-arch)
- CloudWatch (custom metrics + alarms)
- DynamoDB (prompt registry + message bus)
- EventBridge (automation triggers)
- IAM (least privilege + PassRole)

## 💡 Why I Built This
| Question | Answer |
|----------|--------|
| **Why AgentCore?** | Serverless containers — no EC2 to manage, auto-scales, built-in observability, $0 when idle |
| **Why Guardrails?** | Production agents MUST filter harmful content, redact PII, block prompt injection |
| **Why CI/CD?** | Prompt changes weekly. Without automation, you're doing manual deploys forever |
| **Why Evaluation?** | A broken prompt in production = bad answers to real users. Quality gates catch this |
| **Why MCP Gateway?** | Existing APIs shouldn't be rewritten. Gateway exposes them as agent tools instantly |
| **Why Cedar?** | IAM controls WHO can call the agent. Cedar controls WHAT the agent can do per user |
| **Why Memory?** | An agent that forgets every conversation is useless for real workflows |

### Pipeline Flow
git push → EventBridge → CodePipeline → CodeBuild (ARM64):
1. Run evaluation (LLM-as-Judge on 50 test cases)

## 🔥 Part 4: Challenges Faced & Solutions
### Every Error I Hit (And Exactly How I Fixed It)
| # | Error | Root Cause | Fix |
|---|-------|-----------|-----|
| 1 | `exit code 252` on deploy | Wrong CLI: `bedrock-agentcore` vs `bedrock-agentcore-control` | Control plane = `bedrock-agentcore-control`, data plane = `bedrock-agentcore` |
| 2 | `Architecture incompatible: arm64` | CodeBuild default is x86_64, AgentCore needs ARM | Switch to `ARM_CONTAINER` + `amazonlinux-aarch64-standard:3.0` |
| 3 | `429 Too Many Requests` from Docker Hub | Docker Hub rate limits anonymous pulls | Use `public.ecr.aws/docker/library/python:3.13-slim` instead |
| 4 | `AccessDeniedException: iam:PassRole` | CodeBuild role can't pass execution role to AgentCore | Add `iam:PassRole` for the agent execution role ARN |
| 5 | `Agent artifact type cannot be updated` | Can't switch from container to code artifact | Stick with container deployments once created |
| 6 | YAML multi-line parsing errors in buildspec | Complex JSON in shell commands breaks YAML | Write JSON to file: `printf '{}' > /tmp/update.json && --cli-input-json file:///tmp/update.json` |
| 7 | `Model marked as Legacy` | Old model ID `claude-sonnet-4-20250514-v1:0` deprecated | Use active inference profile: `us.anthropic.claude-sonnet-4-6` |
| 8 | `on-demand throughput not supported` | Bare model ID needs provisioned throughput | Add `us.` prefix for inference profile (on-demand) |
| 9 | Guardrail blocks valid inputs | Sensitivity too high on content filter | Tune: INSULTS to MEDIUM, keep HATE/VIOLENCE at HIGH |
| 10 | Evaluation flaky (different scores each run) | Temperature too high on judge model | Set judge temperature to 0.0 for deterministic scoring |
| 11 | MCP Gateway auth fails intermittently | Cognito token expiration (1 hour) | Add token refresh logic before gateway calls |
| 12 | Memory recall returns empty | Wrong namespace in memory search | Match exact namespace used during `put_memory` |

# → Evaluate → Build → Push → Deploy → Verify → Done ✅
## 💰 Cost Analysis
| Component | Monthly Cost | Notes |
|-----------|-------------|-------|
| AgentCore Runtime | ~$5-15 | Session-based, $0 when idle |
| Claude Sonnet 4 (tokens) | ~$10-30 | Depends on usage volume |
| ECR Storage | ~$0.10 | ~150MB image |
| CodeBuild (ARM64) | ~$5 | 10-15 builds × 3 min |
| CodePipeline | $1 | Per pipeline/month |
| CloudWatch (logs + metrics) | ~$3 | Custom metrics + alarms |
| DynamoDB (prompt registry) | ~$1 | On-demand, low volume |
| Bedrock Guardrails | ~$1-3 | Per assessment |
| Evaluation (judge model) | ~$2-5 | 50 test cases per eval |
| **TOTAL** | **~$30-75/month** | Light-to-medium usage |
## 📚 Key Takeaways
| # | Lesson |
|---|--------|
| 1 | **ARM64 from day one** — AgentCore requires it, saves 2+ failed builds |
| 2 | **Guardrails + custom injection defense** — belt AND suspenders for security |
| 3 | **Evaluate BEFORE deploy** — quality gates catch broken prompts before production |
| 4 | **`--cli-input-json file://`** — never fight shell escaping for complex JSON |
| 5 | **`bedrock-agentcore-control`** for management, `bedrock-agentcore` for invocations |
| 6 | **Temperature 0.0 for judge models** — deterministic evaluation scores |
| 7 | **MCP Gateway = zero-code API integration** — don't rewrite APIs as tools |
| 8 | **Cedar policies complement IAM** — IAM = who can call agent, Cedar = what agent can do |
| 9 | **Memory enables real workflows** — agents without memory are just chatbots |
| 10 | **Log everything** — structured JSON to CloudWatch, you'll need it for debugging |

## 🎯 Part 5: AgentCore Harness Service — The Managed Agent Loop
### What is AgentCore Harness?
Every agent has an orchestration loop: call the model → pick tools → execute → pass results back → manage context → handle failures. The **AgentCore Harness** is a fully managed service that turns this entire loop into **configuration, not code**.
┌─────────────────────────────────────────────────────────────────────────┐
│ AgentCore HARNESS vs RUNTIME — When to Use What │
├─────────────────────────────────────────────────────────────────────────┤
│ │
│ HARNESS (Managed Agent Loop) RUNTIME (Your Container) │
│ ───────────────────────────── ──────────────────────── │
│ • You declare: model, tools, • You build: full agent │
│ skills, instructions code in a Docker container │
│ • AWS manages: compute, memory, • You manage: agent logic, │
│ identity, scaling, isolation error handling, context │
│ • Built-in: code interpreter, • Full control: any │
│ browser, filesystem, shell framework, any logic │
│ • Config change = new behavior • Code change = rebuild │
│ • Isolated microVM per session • Container per session │
│ • Multi-model: switch mid-session • You choose model once │
│ │
│ USE HARNESS WHEN: USE RUNTIME WHEN: │
│ • Standard agent patterns • Custom orchestration logic │
│ • Quick iteration on prompts/tools • Existing agent framework │
│ • Need code interpreter + browser • Complex multi-step flows │
│ • Want managed evaluation loop • Need specific dependencies │
│ • A/B testing prompt variants • Full control over everything│
│ │
│ BOTH SUPPORT: │
│ • AgentCore Evaluations (LLM-as-Judge) │
│ • AgentCore Gateway (MCP tools) │
│ • AgentCore Memory (cross-session) │
│ • AgentCore Observability (traces) │
│ • Cedar Policies (authorization) │
└─────────────────────────────────────────────────────────────────────────┘
### Harness Key Features
| Feature | What It Does |
|---------|-------------|
| **Stateful Sessions** | Each session runs in an isolated microVM — filesystem, shell, memory persist |
| **Multi-Model** | Switch between Bedrock, OpenAI, Gemini, LiteLLM mid-session |
| **Built-in Code Interpreter** | Agent writes and executes code in its own sandbox |
| **Built-in Browser** | Agent can browse web pages for research |
| **AWS Skills** | Attach pre-built skills from Git, S3, or AWS catalog with a toggle |
| **S3/EFS Mounting** | Share data across sessions via mounted storage |
| **Configuration Bundles** | Version your agent config (prompt + tools) independently of code |
| **Bring Your Own Container** | Custom environment when you need specific dependencies |
## 🧪 Part 6: AgentCore Evaluations — LLM-in-the-Loop Quality Testing
### What is AgentCore Evaluations?
AgentCore Evaluations scores your agent's production traces using **LLM-as-a-Judge evaluators**. It answers: "Is my agent actually doing a good job on real traffic?"
### Evaluation Types
| Type | When | How |
|------|------|-----|
| **Online** | Every live session | Scores each session as it happens (real-time) |
| **On-Demand** | Single trace debugging | Score one specific trace manually |
| **Batch** | Historical analysis | Run evaluators over past traces in bulk |
| **Test Dataset** | CI/CD quality gate | Fixed golden test set, run before deploy |
| **Simulation** | Stress testing | Synthetic LLM-backed users exercise the agent |
### Built-in Evaluators (LLM-as-Judge)
| Evaluator | What It Measures |
|-----------|-----------------|
| **Helpfulness** | Did the agent actually solve the user's problem? |
| **Faithfulness** | Did the agent stick to facts/context (no hallucination)? |
| **Safety** | Was the response free of harmful/toxic content? |
| **Tool Accuracy** | Did the agent pick the right tool for the task? |
| **Goal Attainment** | Did the agent complete the end-to-end task? |
| **Custom** | Your own evaluator logic (any criteria you define) |
### The Evaluation → Optimization Loop
CAPTURE TRACES → EVALUATE (LLM-as-Judge) → RECOMMEND → A/B TEST → SHIP WINNER
▲ │
└────────────────────────────────────────────────────────────────────┘
Continuous improvement loop
1. **Traces** — Every agent action auto-traced (OpenTelemetry-compatible)
2. **Evaluate** — Score with built-in or custom evaluators
3. **Recommend** — AgentCore generates prompt/tool description improvements
4. **Validate** — A/B test via Gateway: split traffic, measure with confidence intervals
5. **Ship** — Promote winner to 100% traffic
### Console Navigation — What to See and Where

## ✅ FINAL DEPLOYMENT STATUS
### 🔥 Challenge: Getting Evaluation Logs to Work (Troubleshooting Journey)
This was the hardest part. Here's exactly what happened and how I fixed it:
**Problem:** AgentCore Online Evaluation was configured (ACTIVE + ENABLED) but **zero evaluation scores appeared** in the results log group — even after 20+ successful invocations.
**Root Cause Discovery (Step by Step):**
| Step | What I Tried | Result |
|------|-------------|--------|
| 1 | Created online eval config with 9 evaluators | ✅ Config created, status: ENABLED |
| 2 | Invoked agent 16+ times | ✅ All invocations succeeded |
| 3 | Checked eval results log group | ❌ 0 streams, no scores |
| 4 | Waited 15 minutes | ❌ Still nothing |
| 5 | Compared with Harness runtime logs | 💡 Harness has `[trace_id=... span_id=... resource.service.name=...]` |
| 6 | Checked our container logs | ❌ Plain text: `[INFO] Received: ...` — NO trace context |
| 7 | Realized: evaluator reads **OpenTelemetry traces**, not plain logs | 💡 **ROOT CAUSE FOUND** |
**The Fix:**
The AgentCore evaluator parses **structured OpenTelemetry traces** (with trace_id, span_id, service.name). Our container was just printing plain Python logs.
Per AWS docs, for container runtimes you need:
1. Add `aws-opentelemetry-distro>=0.10.0` to `requirements.txt`
2. Change Dockerfile CMD to: `opentelemetry-instrument python main.py`
That's it! The ADOT SDK automatically:
- Instruments Strands agent framework
- Instruments all Bedrock API calls
- Instruments tool invocations
- Exports traces to CloudWatch in the format evaluators expect
**Before (no traces — evaluator can't score):**
2026-07-24 18:02:44 [INFO] llmops-agent: Received: List all EC2 instances
2026-07-24 18:02:48 [INFO] llmops-agent: Completed successfully
**After (with OTEL — evaluator can now score):**
2026-07-25 18:41:34 INFO [llmops-agent] [main.py:56] [trace_id=0 span_id=0 resource.service.name=llmops_agent.DEFAULT] - LLMOps Agent starting
**Key Lesson:** For AgentCore container runtimes, OpenTelemetry is NOT automatic — you must add the ADOT SDK. For Harness-based agents, it's built-in. This is documented but easy to miss.
### 🔥 Challenge 2: OTLP Trace Export — 403 Forbidden
**Problem:** After enabling OTEL, traces were generated (`trace_id=6a65058e91b1cdc7e080432528816b32 trace_sampled=True`) but export failed:
ERROR [opentelemetry.exporter.otlp.proto.http.trace_exporter] - Failed to export span batch code: 403, reason: Forbidden
**Root Cause:** The IAM execution role didn't have permission to write telemetry to AgentCore's observability backend.
**Fix:** Added IAM policy `AgentCoreObservabilityExport`:
{
"Effect": "Allow",
"Action": [
"bedrock-agentcore:PutTelemetry",
"bedrock-agentcore:PutSpans",
"bedrock-agentcore:PostSpans",
"xray:PutTraceSegments",
"xray:PutTelemetryRecords"
],
"Resource": "*"
}
### 🔥 Challenge 3: Environment Variables for OTEL Configuration
**Problem:** Even with ADOT SDK in requirements and `opentelemetry-instrument` in CMD, traces showed `trace_sampled=False` and weren't being exported.
**Fix:** Set these environment variables on the AgentCore runtime:
AGENT_OBSERVABILITY_ENABLED=true
OTEL_TRACES_EXPORTER=otlp
OTEL_LOGS_EXPORTER=otlp
OTEL_PYTHON_DISTRO=aws_distro
OTEL_PYTHON_CONFIGURATOR=aws_configurator
OTEL_PROPAGATORS=baggage,xray,tracecontext
OTEL_EXPORTER_OTLP_PROTOCOL=http/protobuf
OTEL_RESOURCE_ATTRIBUTES=service.name=llmops_agent
**Result after all 3 fixes applied:**
[trace_id=6a65058e91b1cdc7e080432528816b32 span_id=152dfa54c3db07b0 resource.service.name=llmops_agent trace_sampled=True]
- Creating Strands MetricsClient (TRACE ACTIVE!)
### Complete Fix Summary (3 steps for container runtime tracing):
| Step | What | Why |
|------|------|-----|
| 1 | Add `aws-opentelemetry-distro>=0.10.0` to requirements.txt | Installs ADOT SDK |
| 2 | CMD: `opentelemetry-instrument python main.py` | Auto-instruments Strands + Bedrock |
| 3 | Set OTEL env vars on runtime + add IAM `PutTelemetry` permission | Enables export to AgentCore backend |
## 💰 Part 8: Cost Optimization — Nova Pro vs Claude Sonnet
### Cost-Optimized Model Routing

### Why Nova Pro (Not Claude Sonnet)
| Model | Input $/1M | Output $/1M | Monthly (1K calls) | AWS Credits |
|-------|-----------|-------------|-------------------|-------------|
| Claude Sonnet 4 | $3.00 | $15.00 | ~$50-80 | ❌ Not covered |
| **Nova Pro (our choice)** | **$0.80** | **$3.20** | **~$12-20** | **✅ Covered** |
| Nova Lite (cheapest) | $0.06 | $0.24 | ~$1-2 | ✅ Covered |
**Result: 78% cost reduction vs Claude Sonnet — fully covered by AWS credits.**
### Model Routing Strategy
def select_model(prompt: str) -> str:
"""Route simple queries to Lite, complex to Pro."""
simple_patterns = ["list", "status", "health", "what can you"]
if any(p in prompt.lower() for p in simple_patterns) and len(prompt) < 100:
return "us.amazon.nova-lite-v1:0" # $0.06/1M
else:
return "us.amazon.nova-pro-v1:0" # $0.80/1M
| Query Type | Traffic | Model | Cost/1M |
|-----------|---------|-------|---------|
| Simple (list, status) | ~70% | Nova Lite | $0.06 |
| Complex (diagnose, fix) | ~30% | Nova Pro | $0.80 |
| **Blended** | 100% | Mix | **~$0.28** |
### Evaluator: Keep Nova Pro (Don't Cheap Out on Judge)
A cheap judge (Nova Lite) gives unreliable scores → worse than no evaluation. The judge must be **same quality or higher** than the agent.
### Monthly Cost (This Deployment)
| Component | Cost |
|-----------|------|
| AgentCore Runtime (idle) | $0 |
| Nova Pro (agent + eval) | ~$7-20 |
| CodeBuild | ~$5 |
| DynamoDB + CloudWatch + ECR | ~$4 |
| **TOTAL** | **~$16-30/month (all AWS credits)** |
